Extending the RAG Pipeline in My AI FPL Agent, Part II: Scale

Last time, I showed how I extended my FPL agent with injury context and expert insights. This created a more informative and detailed pipeline, but it also exacerbated an ongoing problem: the model's ability to process large amounts of player information.

In this post I'll lay out my solution for tackling that issue.

Extension 3: Handling the Scale

Even before we added injury context and expert insights, the model was already struggling with scale. We provide 600+ players, which is a lot for any LLM to process effectively. Adding two extra lines per player for injury and expert tips will only make the problem worse: the prompt is now bigger, more complex and still includes a lot of players who realistically shouldn't be considered.

For example, a young player like Josh Nichols - marked as Avoid and unlikely to feature - is a clear candidate for immediate exclusion. Players flagged as Out, like Mikel Merino, should be deprioritised, while players marked as Must-have and Fit, like Viktor Gyökeres, should be given top consideration.

To prevent token bloat and keep the model focused, we pre-filter and rank players before building the final team-building prompt. This ensures the model sees only the players worth considering and can reason over them more effectively.

Why Build This Extension

The enrichments made the prompts bigger and more informative, but that also exacerbated an existing scale problem, increasing token usage and processing cost on model APIs like OpenRouter. Many players will never be selected and redundant data makes the model's reasoning harder. By shortlisting players based on both quantitative stats and qualitative enrichments, I:

  • Remove players unlikely to play or score points.
  • Prioritise Must-have and Recommended players.
  • Reduce prompt size from 600+ to ~120 players (customisable).
  • Give the model a ranked, manageable list to reason over.

How I Solved This

Determining which items to select from a long list is a classic problem - one that has been essential to the success of many large-scale organisations. For example, Netflix needs to recommend movies to users from a huge catalogue. They do this by turning information about each movie (e.g., the summary, genre and audience appeal) into a numerical encoding. Similar movies end up with similar encodings - so if you liked Interstellar, you'll probably like The Martian or Inception, and you'll see them recommended along side each other, while you're unlikely to ever see Bambi recommended alongside those. It's a well-established and highly effective way to recommend items to users.

Embeddings For Movies

This numerical encoding is called an embedding. Essentially, it's a way to turn text into a vector so that we can measure how similar two items are. There are many ways to create embeddings, but fortunately there are plenty of pre-trained models available that can generate embeddings out of the box. These models are trained on massive amounts of text to learn the meaning of words and sentences, so that texts with similar content end up close together in a high-dimensional vector space.

I can use the same approach to rank and shortlist players for Fantasy Premier League, turning each player's stats, injury context and expert insights into embeddings.

The Process

  1. Build Player Text Blobs

Each player is converted into a single text snippet combining their stats, injury news and expert insights. For example:

  1. Embed Each Player

I use a lightweight embedding model (BAAI/bge-base-en-v1.5) to convert each player text blob into a 768-dimensional vector. I opted for this model because it's a small, fast, English-focused model that runs locally with no API. It's also well-supported and widely used.

  1. Embed Positional Queries

I then query the embeddings to identify players matching key criteria - must-have players, who are fit, likely to play and score points. I do this by writing a query and embedding the query with the same model. Players' embeddings are then compared to the query embedding to measure relevance.

As it turns out each position is very different, so I use a different query for each position.

GK: "Must-have OR recommended, fit, high points, clean sheet, saves, consistent starter, good fixtures. NOT out of form, injured, suspended."

  1. Compute Similarity

I compute cosine similarity between each player's embedding and the query embedding for their position. This produces a raw relevance score, naturally ranking players by how well they match the desired profile.

Declan Rice: 0.701
Josh Nichols: 0.654
Viktor Gyökeres: 0.688

These scores are tightly clustered together, which isn't surprising since they're all footballers with similar language in their text blobs. All scores lie within a narrow range of 0.602-0.701. Scaling the raw similarity scores from 0.602-0.701 to a 0-10 range provides more intuitive separation between players, making differences easier to interpret.

This is not perfect and scaling needs thought, but it gives a clearer idea of each player's ranking given the range is so tight.

Interestingly, if I run an embedding search for a player against the wrong positional query, I get a different score - one that reflects that position a bit more.

Declan Rice (for GK): 0.663 (or 6.16 when scaled)

Rice scores much lower when compared to the GK query than his native MID position, since things like saves aren't as important to him.

This naturally ranks players even with a tight score range. However, some important signals in the enrichments - like flags for "Must-have" or "Avoid" - may be missed by embeddings alone. To ensure these critical indicators influence the ranking, I combine the embedding score with a keyword bonus in the hybrid scoring step. This ensures that critical qualitative insights from expert flags are reflected in the final ranking, even if the embeddings alone might not fully capture them.

Rather than over-optimising the scaling of cosine similarity scores, I chose to rely on keyword flags to prioritise key players (e.g., must-haves). Cosine similarity then fine-tunes the order among them, preventing large outliers caused solely by embedding variance.

  1. Combine with Keyword Bonus and Score

I extract the flag from the expert insights (Must-have, Recommended, Rotation risk, Avoid) and map it to a numeric bonus:

Then I calculate a hybrid score:

hybrid = 0.6 × embedding_score + 0.4 × keyword_bonus

For example:

These hybrid scores feel better informed and more accurately reflect each player's ranking.

  1. Shortlist

I then take the top K players per position, where K is a configurable number, and rank them descending by hybrid score.

  • 40 DEF
  • 50 MID
  • 20 FWD

I selected these numbers as they felt a fair ratio between players in each position in the league and positions available in the team with FPL enforcing 2 goalkeepers, 5 defenders, 5 midfielders and 3 forwards.

Players marked "Out" or with < 25% chance of playing are removed before shortlisting. Major doubts and rotation risks remain for the model to consider.

  1. Building the Team-Building Prompt

Only the shortlisted players are included in the final prompt, along with their stats, injury context, expert insights and hybrid score. Here's a snippet for the must-have forwards:

With this approach, the model sees ~120 high-priority players instead of 600+, keeping token usage manageable and ensuring reasoning focuses on realistic options.

Putting It All Together

These extensions, with the enriched information and shortlisting, mean I've now created a more informed and efficient team-building process. By combining player stats, injury context, expert insights and hybrid embedding scores, the model now has a rich, structured view of the entire FPL universe without being overwhelmed by unnecessary information.

The model now has:

  • Focused reasoning it can tap into for each player and use to make better decisions.
  • Richer qualitative information for each player with expert insights and injury context to support the stats.
  • Better prioritisation by filtering out players marked as Out as well as those with < 25% chance of playing.
  • Hybrid scoring which balances the keyword bonuses and rankings to produce a clear score for each player the model can use to make better decisions and filter out low-priority players.

This is my new architecture.

Once again it makes sensible captaincy decisions picking a double gameweek player. There is also better budget utilisation, which may be a consequence of the improved ranking - although it's hard to attribute that definitively. This time it does select more double gameweek players like, Ladislav Krejcí and João Victor Gomes da Silva, clearly referencing the hints/tips on this, "solid budget option for the double gameweek" and "a consistent starter in midfield with high FPL potential through his all-round contributions, making him a strong pick for the double gameweek". Both were entirely overlooked in the original team building prompt, given they appear alongside 600 other players and it's not explicitly clear they will feature in a double gameweek. The enrichments and rankings now make this much clearer to the model and clearly influence its decision-making.

There are still some overlapping players in both teams, but this time it skipped players like Hollingshead who don't make it through the filtering process and are marked as Avoid. It also skipped midfield starters like Bruno Guimarães (3), Scott (15), Anderson (24) and Enzo Fernandes (34), favouring higher-ranked players like Palmer (4), Foden (6), Bruno Fernandes (7) and Gomes sa Silva (10). This again shows it's leaning on the enrichments and rankings for making its decisions.

This doesn't guarantee better performance - FPL is inherently volatile - but the decision-making process is clearly more structured and informed. The model is now selecting players for coherent, explainable reasons rather than sampling from an undifferentiated pool.

Over a full season, I would expect this structured approach to outperform a naïve prompt - not because the model is smarter, but because the information it receives is better organised and prioritised.

Conclusion

In this project, I've built a robust pipeline for Fantasy Premier League team-building that combines multiple layers of information and intelligent filtering:

  1. Data enrichment: Player stats, injury context and expert insights are used to build the team with the latest information.
  2. Scaling and ranking: I rank players by position using embeddings to determine the top players to select.
  3. Hybrid scoring: I combine embedding similarity with keyword bonuses to account for critical flags like "Must-have" or "Avoid".
  4. Shortlisting: Only the top-ranked players per position are included in the final prompt, keeping token usage manageable and reasoning focused.
  5. Team-building: The model receives a curated, high-priority set of players, allowing it to make well-informed selections efficiently.

This approach ensures the model sees a realistic and prioritised player set, improves reasoning quality and mitigates the problems of information overload encountered in earlier iterations.
